NeuralSymbolic

Neural-symbolic AI combines neural networks with symbolic reasoning to fuse data-driven learning with explicit knowledge and logic. It aims to capitalize on the pattern recognition strengths of neural models while enabling structured, interpretable inference using rules, ontologies, or logical formalisms. The goal is systems that learn from data and also reason about concepts, relationships, and constraints in a human-interpretable way.

Approaches include integrating neural perceptual modules with symbolic reasoners and embedding symbolic structures in neural architectures via differentiable representations. Techniques span differentiable logic, probabilistic reasoning over knowledge bases, and neuro-symbolic program induction or graph-based rule grounding. A common theme is translating symbolic knowledge into forms usable by neural computation and vice versa, so that learning and reasoning can proceed in a unified framework.

Applications cover natural language understanding and reasoning, visual question answering with constraint-based inference, robotics and planning, program synthesis, and scientific or medical decision support. These domains benefit from combining robust perception with explicit, rule-based inference.

Challenges involve scaling reasoning to large knowledge graphs, ensuring interpretability and reliability, reconciling symbolic inaccuracies with statistical learning, and achieving robust transfer across tasks and domains. Additional work addresses the theoretical foundations of combining discrete logic with continuous optimization and the development of standardized benchmarks for evaluation.
